Synthetic data has gone from an academic curiosity to an enterprise line item in under two years. Teams that were cautiously prototyping in 2022 are now generating millions of synthetic records to train models, test pipelines, and move data across boundaries that wouldn’t allow real production data to cross. The appeal is obvious — privacy-safe, abundant, customizable — and the pitfalls are real. Getting it right in 2024 requires more care than the vendor pitches suggest.

Why the Interest Is Real

The underlying problems synthetic data addresses are not imaginary:

Real data is constrained by privacy regulation — GDPR, HIPAA, CCPA, and sector-specific rules — in ways that limit where and how it can be used. Synthetic data, if generated with proper guarantees, can move more freely across teams, vendors, and environments.

Real data is unbalanced. Rare events, minority classes, and long-tail scenarios are, by definition, under-represented. Synthetic generation can oversample these without inflating overall dataset size.

Real data is expensive to label. Synthetic generation can produce labels deterministically as part of the process — cheaper and more consistent than human annotation for many tasks.

Real data may not exist yet. For simulations of future products, new regulations, or rare-event response, synthetic generation is the only option.

The Three Methods and Where They Each Fit

Three generation approaches dominate the enterprise landscape:

Statistical methods (copulas, GANs, variational autoencoders). These model the joint distribution of the original data and sample from it. Mature, well-understood, and the right default for structured tabular data where statistical fidelity is the primary concern. Open and commercial tools (SDV, Gretel, Mostly AI, Tonic) have matured substantially.

LLM-based generation. Prompting an LLM to produce records that look like examples — sometimes called “prompt-based generation” — is now common for text, customer-service transcripts, survey responses, and other unstructured data. Flexible, often surprisingly good, but harder to characterize in terms of fidelity and privacy.

Simulation-based generation. For sensor data, agent interactions, or physical environments, simulators produce synthetic data with explicit generative models. This is dominant in autonomous driving, robotics, and some financial modeling, and increasingly relevant for training LLM agents on scenarios that are expensive to stage with real users.

The right method depends on the data type, the downstream use, and the fidelity required.

The Privacy Question Is Harder Than It Looks

The most dangerous assumption about synthetic data is that it’s automatically privacy-preserving. It isn’t.

Models trained on real data can memorize specific records and reproduce them verbatim, especially for outliers that the model had few examples of. The classic failure mode: a synthetic “privacy-safe” dataset that inadvertently leaks a distinctive real customer’s record almost intact. This isn’t a theoretical concern; it has been demonstrated repeatedly across modalities.

Serious synthetic-data programs now pair generation with explicit privacy guarantees. Differential privacy during training provides mathematical bounds on what any single record can contribute to the output. Membership inference testing measures whether it’s possible to tell if a specific record was in the training set. Record-level similarity scans check whether generated records are suspiciously close to real ones.

The honest framing: synthetic data is a privacy tool when combined with the right controls, and a privacy risk when deployed without them.

The Bias Question

Synthetic data inherits — and can amplify — biases from its source. If women are under-represented in loan-approval data, a naive synthetic dataset will carry that forward. Worse, some generation methods smooth over the minority distribution in ways that reduce its visibility, making bias harder to detect in the synthetic version than in the original.

The mature practice is to be explicit about distribution targets: if the original data under-represents a group, decide whether the synthetic data should match that distribution (preserving the representational problem) or rebalance (creating a potentially unrealistic distribution). Both choices have consequences; neither is automatically correct.

Use Cases Working in Production

A few patterns show up consistently in successful enterprise synthetic-data programs:

Environment populating. Staging and development environments populated with synthetic data that matches production in structure and statistical character, but contains no real PII. This has become a near-default practice where the operational tooling is mature enough.

Rare-event augmentation. Fraud, churn, safety-critical events — rare by nature, scarce in data. Synthetic augmentation targeted specifically at the rare class (rather than the whole dataset) often improves downstream model performance.

Cross-boundary data sharing. Between business units, with vendors, with regulators — where real data movement is blocked or expensive, synthetic data with documented privacy properties has become a practical workaround.

LLM training augmentation. High-quality synthetic data generated by stronger LLMs is now widely used to train or fine-tune smaller ones. The technique works, but requires care — training on synthetic data generated by the model you’re trying to beat tends to cap performance at the generator’s ceiling.

Use Cases That Consistently Disappoint

Where synthetic data tends to fall short in ways people underestimate:

Preserving subtle multivariate relationships that matter for downstream analytics. Generation methods can produce plausible univariate and pairwise distributions while missing higher-order structure. Power analysts tend to find the gaps quickly.

Regulatory acceptance. Even well-generated synthetic data is not always accepted by regulators as a substitute for real data analysis. This varies by jurisdiction and sector; confirm before committing the program.

Foundation-model training without guardrails. Training on largely synthetic data can lead to distribution collapse over generations — a well-documented phenomenon sometimes called “model collapse.” Synthetic data is an augmentation, not a replacement, for real data in large-scale pretraining.

Conclusion

Synthetic data in 2024 is a practical, valuable tool when used for the right problems with the right controls. It is not magic privacy dust, not a substitute for real-world data in contexts that require it, and not free of the biases and limitations of its source. The enterprises getting durable value are those treating it as one more tool in the data-management stack, with the evaluation and governance rigor that any production data pipeline deserves.
